Abstract

In the present work, we propose a neural network based data inversion approach to reduce structured contamination sources, with a particular focus on the mapmaking for Planck High Frequency Instrument (Planck-HFI) data and the removal of large-scale systematic effects within the produced sky maps. The removal of contamination sources is rendered possible by the structured nature of these sources, which is characterized by local spatiotemporal interactions producing couplings between different spatiotemporal scales. We focus on exploring neural networks as a means of exploiting these couplings to learn optimal low-dimensional representations, optimized with respect to the contamination source removal and mapmaking objectives, to achieve robust and effective data inversion. We develop multiple variants of the proposed approach, and consider the inclusion of physics informed constraints and transfer learning techniques. Additionally, we focus on exploiting data augmentation techniques to integrate expert knowledge into an otherwise unsupervised network training approach. We validate the proposed method on Planck-HFI 545 GHz Far Side Lobe simulation data, considering ideal and non-ideal cases involving partial, gap-filled and inconsistent datasets, and demonstrate the potential of the neural network based dimensionality reduction to accurately model and remove large-scale systematic effects. We also present an application to real Planck-HFI 857 GHz data, which illustrates the relevance of the proposed method to accurately model and capture structured contamination sources, with reported gains of up to one order of magnitude in terms of contamination removal performance. Importantly, the methods developed in this work are to be integrated in a new version of the SRoll algorithm (SRoll3), and we describe here SRoll3 857 GHz detector maps that will be released to the community., Comment: 16 pages, 8 figures

Abstract

Super-resolution is a classical problem in image processing, with numerous applications to remote sensing image enhancement. Here, we address the super-resolution of irregularly-sampled remote sensing images. Using an optimal interpolation as the low-resolution reconstruction, we explore locally-adapted multimodal convolutional models and investigate different dictionary-based decompositions, namely based on principal component analysis (PCA), sparse priors and non-negativity constraints. We consider an application to the reconstruction of sea surface height (SSH) fields from two information sources, along-track altimeter data and sea surface temperature (SST) data. The reported experiments demonstrate the relevance of the proposed model, especially locally-adapted parametrizations with non-negativity constraints, to outperform optimally-interpolated reconstructions., Comment: 4 pages, 3 figures

Abstract

In the last few decades, the ever-growing availability of multi-source ocean remote sensing data has been a key factor for improving our understanding of upper ocean dynamics. In this regard, developing efficient approaches to exploit these datasets is of major importance. Particularly, the decomposition of geophysical processes into relevant modes is a key issue for characterization, forecasting and reconstruction problems. Inspired by recent advances in blind source separation, we aim, in the first part of this thesis dissertation, at extending non-negative blind source separation models to the problem of the observation-based characterization and decomposition of linear operators or transfer functions between variables of interest. We develop mathematically sound and computationally efficient schemes. We illustrate the relevance of the proposed decomposition models in different applications involving the analysis and forecasting of geophysical dynamics. Subsequently, given that the ever-increasing availability of multi-source datasets supports the exploration of data-driven alternatives to classical model-driven formulations, we explore recently introduced data-driven models for the interpolation of geophysical fields from irregularly sampled satellite-derived observations. Importantly, with a view towards the future SWOT mission, the first satellite mission to produce complete two-dimensional wide-swath satellite altimetry observations, we focus on assessing the extent to which SWOT data may lead to an improved reconstruction of altimetry fields.; Au cours des dernières années, la disponibilité toujours croissante de données de télédétection multi-source de l'océan a été un facteur clé pour améliorer notre compréhension des dynamiques de la surface de l'océan. A cet égard, il est essentiel de mettre au point des approches efficaces pour exploiter ces ensembles de données. En particulier, la décomposition des processus géophysiques en modes pertinents est une question clé pour les problèmes de caractérisation, de prédiction et de reconstruction. De plus, en vue de la future mission SWOT, la première mission satellitaire à produire des observations d'altimétrie par satellite complètement bidimensionnelles et à large fauchée, nous nous intéressons à évaluer dans quelle mesure les données SWOT permettraient une meilleure reconstruction des champs altimétriques.

8. Analog data assimilation of along-track nadir and wide-swath SWOT altimetry observations in the Western Mediterranean sea

Abstract

The growing availability of ocean data brought forth by recent advancements in remote sensing, in situ measurements, and numerical models supports the development of data-driven strategies as a powerful, computationally efficient alternative to model-based approaches for the interpolation of high-resolution, gap-free, regularly gridded sea surface geophysical fields from partial satellite-derived observations. In this paper, we investigate such data-driven strategies for the spatio-Temporal interpolation of sea level anomaly (SLA) fields in the Western Mediterranean Sea from satellite-derived altimetry data. We introduce and evaluate the analog data assimilation (AnDA) framework, which exploits patch-based analog forecasting operators within a classic Kalman-based data assimilation scheme. With a view toward the upcoming wide-swath surface water and ocean topography (SWOT) mission, two different types of altimetry data are assimilated: Along-Track nadir data and wide-swath SWOT altimetry data. Using an observing system simulation experiment, we demonstrate the relevance of AnDA as an improved interpolation method, particularly for mesoscale features in the 20-to 100-km horizontal scale range. Results report an SLA reconstruction RMSE (correlation) improvement of 42% (14%) with respect to optimal interpolation, and show a clear gain when the joint assimilation of SWOT and along-Track nadir observations are considered.

Current generation satellite altimetry missions have played a fundamental role in improving our understanding of sea surface dynamics, despite only being able to provide measurements along the satellite track. In this respect, the future SWOT altimetry mission will be the first mission to produce complete two-dimensional wide-swath satellite observations. With a view towards the upcoming SWOT mission launch, we explore the potential of SWOT observations to improve the reconstruction of high-resolution sea level anomaly (SLA) fields from satellite-derived data. Given the ever-increasing availability of multi-source datasets that supports the exploration of data-driven alternatives to classical model-driven formulations, we focus here on recently introduced data-driven models for the interpolation of geophysical fields. Using an Observing System Simulation Experiment (OSSE), we demonstrate the relevance of SWOT observations to better constraint data-driven interpolation models in order to improve the reconstruction of mesoscale features. Reported results suggest that SWOT observations can provide more information than currently available nadir along-track al-timetry observations and show an additional SLA reconstruction performance improvement when the the joint assimilation of SWOT and nadir along-track observations is considered.

Abstract

The problem of observation-based characterization of operators, closely related to the well-studied problem of blind source separation, remains nonetheless considerably less studied. Inspired by the recent success of non-negative and sparse blind source separation, we aim at extending constrained blind source separation models to the data-driven characterization of operators. We introduce a novel non-negative decomposition model for linear operators and investigate different parameter estimation algorithms. We study and compare the proposed algorithms in terms of identification and reconstruction performance in a variety of experimental settings, in order to gain insight into the robustness and limitations of the proposed algorithms. We further discuss the main contribution of our approach compared with state-of-the-art methods for the analysis and decomposition of operators.

Abstract

International audience; The growing availability of ocean data brought forth by recent advancements in remote sensing, in situ measurements and numerical models supports the development of data-driven strategies as a powerful, computationally-efficient alternative to model-based approaches for the interpolation of high-resolution, gap-free, regularly-gridded sea surface geophysical fields from partial satellite-derived observations. In this work, we investigate such data-driven strategies for the spatio-temporal interpolation of Sea Level Anomaly (SLA) fields in the Western Mediterranean Sea from satellite-derived altimetry data. We develop and evaluate an Analog Data Assimilation (AnDA) framework, which exploits patch-based analog forecasting operators. Two different types of altimetry data are assimilated: along-track nadir data and wide-swath SWOT altimetry data. Using an OSSE, we analyze the sensitivity of the proposed framework to its most relevant internal parameters. We demonstrate the relevance of AnDA as an improved interpolation method, particularly for mesoscale features in the 20-100 km horizontal scale range. Results report an SLA reconstruction RMSE (correlation) improvement of 42% (12%) with respect to Optimal Interpolation (OI), and suggest an additional potential gain when the joint assimilation of SWOT and along-track nadir observations is considered.

Abstract

International audience; The growing availability of multi-source ocean remote sensing data is a key factor for improving our understanding of upper ocean dynamics, ocean circulation and atmospheric-ocean interactions. Following an ongoing body of work that investigates mesoscale upper ocean dynamics from linear couplings between SST (sea surface temperature) and SSH (sea surface height), we propose a novel observation-driven framework for the identification and characterization of sea surface dynamical modes. It relies on a multi-modal decomposition of SST-SSH relationships. Our findings suggest that upper ocean dynamics may be decomposed as the superimposition of several dynamical modes, rather than mutually exclusive ones as investigated in previous work. Our study stresses the relevance of a non-negative bi-modal additive decomposition to capture the complex space-time variability of mesoscale upper ocean dynamics.

Abstract

International audience; In the data mining community, unsupervised classification (or clustering) technics are used to reveal and explore the hidden structure of a dataset. Among them, mixture models and in particular Gaussian Mixture Models (GMM), are a very popular tool. With GMM, the statistical distribution of the dataset is decomposed into a weighted sum of Gaussian modes that maximizes the likelihood of the dataset. Multivariate Gaussian distributions characterize a mode in the D-dimensional space of the dataset. This technic is routinely used in atmospheric science to describe weather regimes but is yet to be explored in physical oceanography. Here, we are interested in determining the structure of the North Atlantic ocean temperature field. Argo profiles in the North atlantic were compressed along their vertical axis in order to reduce the dimensionality of the problem. We then fitted GMMs to this reduced profile dataset according to a Maximum Likelihood criterion using the Expectation-Maximization algorithm. A seven-mode GMM was the most relevant to describe the dataset. Each mode or cluster is characterized by the parameters of a Gaussian distribution (a mean and a covariance matrix). GMM also provides for each profile of the dataset the probability it belongs to a specific cluster. We will show that these informations can be used to describe physically coherent heat reservoirs and their variability. Indeed, we found that clusters capture the large scale climatological structure of the temperature field. Each of the cluster correspond to physically coherent regions, namely the equatorial, tropical, subtropical, intergyre and subpolar regions and are associated with reference profiles. A hierarchical clustering was applied to characterize the regional variability of the dataset. We will present those clusters and possible use both for scientific analysis of the heat content variability in the North Atlantic and technical validation of the Argo array.
