I modelli statistici per serie storiche multivariate sono strumenti utili per comprendere e prevedere le interazioni tra diverse variabili. Le tecniche di clustering temporale aiutano ulteriormente nell'analisi di tali dati, identificando insiemi di serie storiche con tendenze simili nel tempo. Tuttavia, una modellazione accurata è essenziale per migliorare l'accuratezza delle previsioni e la rilevazione delle anomalie. Le serie storiche finanziarie presentano sfide uniche dovute alle loro caratteristiche, come il volatility clustering, le code pesanti, la non linearità e la non normalità. Inoltre, possono sorgere sfide computazionali a causa dell'alta dimensionalità di tali dati. In questa tesi, vengono proposte due metodologie chiave per la modellazione e il clustering di serie storiche finanziarie multivariate. Nel Capitolo 2, si introduce il modello regime switching copula Student-t, un potente strumento per catturare la distribuzione con code pesanti dei rendimenti finanziari in diverse condizioni di mercato. Questo modello combina la flessibilità della distribuzione della copula Student-t con la capacità di cambiare tra stati del mercato. Si propone un nuovo approccio di stima basato su massima verosimiglianza, affrontando le sfide computazionali legate alla stima di tali modelli per dati multivariati. La proposta viene testata attraverso uno studio di simulazione, dimostrando che essa fornisce buoni risultati su campioni finiti. L'approccio proposto viene in seguito applicato per modellare la distribuzione congiunta dei log-rendimenti delle cinque principali criptovalute, dimostrandone l'efficacia nel tracciare le fasi di mercato rialzista e ribassista. Nel Capitolo 3 viene presentato il modello sparse statistical jump, progettato per affrontare le sfide dei dati finanziari ad alta dimensionalità. Esso consente di identificare le variabili chiave all'interno di un insieme ad alta dimensionalità, modellando contemporaneamente la sequenza di stati laten, Multivariate time series models are useful tools for understanding and predicting the interactions among multiple variables. Temporal clustering techniques further aid in analyzing such data by identifying sets of time series that exhibit similar trends over time. However, accurate modeling and clustering are essential for enhancing forecasting accuracy and anomaly detection. Financial time series data present unique challenges due to their characteristics such as volatility clustering, heavy tails, non-linearity, and non-normality. Moreover, computational challenges can arise due to the high-dimensionality of such data. In this thesis, we propose two key methodologies for modeling and clustering multivariate financial time series data, taking into account their characteristics. In Chapter 2, we first introduce the regime switching Student-t copula model, a powerful tool for capturing the heavy-tailed joint distribution of financial returns across different market conditions. This model combines the flexibility of the Student-t copula distribution with the ability to switch between market states. We propose a novel maximum likelihood estimation approach tailored for this model, addressing computational challenges associated with estimating copula models for multivariate data. We test the proposal through an extensive simulation study and we show that it provides good results in finite samples. We apply our approach to model the joint distribution of the five main cryptocurrency log-returns, demonstrating its effectiveness in tracking bull and bear market phases based on cryptocurrency correlations. In Chapter 3, we present the sparse statistical jump model, designed to address the challenges of high-dimensional financial data. In order to evaluate the effect of a policy or treatment with pre- and post-treatment outcomes, we propose an approach based on a transition model, which may be applied with multivariate outcomes and accounts for unobserved heterogeneity. This model is based on potential versions of discrete latent variables representing the individual characteristic of interest and may be cast in the hidden (latent) Markov literature for panel data. Therefore, it can be estimated by maximum likelihood in a relatively simple way. The approach extends the difference-in-difference method as it is possible to deal with multivariate outcomes. Moreover, causal effects may be expressed with respect to transition probabilities. The proposal is validated through a simulation study, and it is applied to evaluate educational programs administered to pupils in the sixth and seventh grades during their middle school period. These programs are carried out in an Italian region to improve non-cognitive skills (CSs). We study if they impact also on students’ CSs in Italian and Mathematics in the eighth grade, exploiting the pretreatment test scores available in the fifth grade. The main conclusion is that the educational programs aimed to develop noncognitive abilities help the best students to maintain their higher cognitive abilities over time.

I modelli a variabili latenti forniscono un approccio statistico fondamentale per l'analisi di dati in molti campi diversi. Tra gli altri, citiamo la psicologia, la sociologia, l'economia, la medicina e l'ingegneria. La popolarità di questi modelli è accresciuta significativamente negli ultimi decenni grazie alla sempre maggiore disponibilità di dati e di risorse computazionali. La tesi è organizzata come segue. Nel Capitolo 1 si forniscono alcune conoscenze di base per i modelli a variabili latenti basati su distribuzioni discrete. In particolare, si analizzano nel dettaglio alcune specifiche classi dei modelli oggetto di studio: modelli latent class (LC), modelli hidden Markov (HM) e modelli stochastic block (SB). Si richiamano le principali assunzioni teoriche alla base di questi modelli a si analizza la stima di massima verosimiglianza per i parametri del modello attraverso l'algoritmo di expectation-maximization (EM). Nel Capitolo 2 si introduce il problema della multi-modalità della funzione di verosimiglianza per i modelli a variabili latenti discrete; si analizza la conseguente convergenza dell'algoritmo EM a massimi locali. Si considera una classe di metodi di ottimizzazione, noti come tempering o annealing, che ricorrono all'utilizzo di un parametro per riscalare la funzione da massimizzare e per monitorare la prominenza di tutti i massimi. Sfruttando queste tecniche, si propone un algoritmo tempered EM per esplorare lo spazio dei parametri in modo adeguato ed accrescere le possibilità di raggiungere il massimo globale. Si confronta la proposta con l'algoritmo EM attraverso uno studio simulativo di tipo Monte Carlo, valutando sia l'abilità di raggiungere il massimo globale della funzione di verosimiglianza, sia il tempo computazionale. Si utilizza la proposta anche su dati di tipo reali in riferimento ad alcune applicazioni di interesse, mostrando i risultati per i modelli LC ed HM. These include, but are not limited to, education, psychology, sociology, economics, medicine, and engineering. The popularity of these models has significantly grown in the last decades due to the increasing availability of data and of computational resources. The thesis is organized as follows. In Chapter 1 we provide basic background knowledge for the latent variable models based on a discrete distribution. In particular, we review in some details specific classes of the models at issue, namely latent class (LC), hidden Markov (HM) and stochastic block (SB) models. We recall the main underlying assumptions and analyze the standard maximum likelihood estimation of model parameters through the expectation-maximization (EM) algorithm. In Chapter 2 we deal with the problem of multimodality of the log-likelihood function of discrete latent variable models, and the consequent possible convergence of the EM algorithm to a local maximum. We introduce a class of optimization methods, namely tempering or annealing, which employ a parameter known as temperature to re-scale the target function and monitor the prominence of all maxima. Exploiting the basic idea of these techniques, we propose a tempered EM algorithm to explore the parameter space adequately and increase the chance to reach the global maximum. We compare the proposal with the standard EM algorithm by an extensive Monte Carlo simulation study, evaluating both the ability to reach the global maximum of the log-likelihood function, and the computational time. We also employ the proposal on cross-sectional and longitudinal data referred to some application of interest, showing the main findings for LC and HM models. Maximum likelihood estimation of discrete latent variable (DLV) models is usually performed by the expectation-maximization (EM) algorithm. A well-known drawback is related to the multimodality of the log-likelihood function so that the estimation algorithm can converge to a local maximum, not corresponding to the global one. We propose a tempered EM algorithm to explore the parameter space adequately for two main classes of DLV models, namely latent class and hidden Markov. We compare the proposal with the standard EM algorithm by an extensive Monte Carlo simulation study, evaluating both the ability to reach the global maximum and the computational time. We show the results of the analysis of discrete and continuous cross-sectional and longitudinal data referring to some applications of interest. All the results provide supporting evidence that the proposal outperforms the standard EM algorithm, and it significantly improves the chance to reach the global maximum. The advantage is relevant even considering the overall computing time.

We review the discrete latent variable approach, which is very popular in statistics and related fields. It allows us to formulate interpretable and flexible models that can be used to analyze complex datasets in the presence of articulated dependence structures among variables. Specific models including discrete latent variables are illustrated, such as finite mixture, latent class, hidden Markov, and stochastic block models. Algorithms for maximum likelihood and Bayesian estimation of these models are reviewed, focusing, in particular, on the expectation-maximization algorithm and the Markov chain Monte Carlo method with data augmentation. Model selection, particularly concerning the number of support points of the latent distribution, is discussed. The approach is illustrated by summarizing applications available in the literature; a brief review of the main software packages to handle discrete latent variable models is also provided. Finally, some possible developments in this literature are suggested.
